FAR.AI proposes the Codebook Features method, adding a quantization bottleneck at each layer that compresses activation vectors into a small number of discrete switch codes in a learned codebook, making the neural network more interpretable and controllable internally, with only a small drop in performance. The method was applied to language models up to 410M parameters, and the discovered codes cover concepts such as punctuation, syntax, lexical semantics, and high-level topics. In experiments, codes predict simple text features better than neurons, and directly activating a code for a concept (such as dragon) makes the network generate relevant text in most cases. Even though the quantization bottleneck compresses the information in activation vectors by more than 100x, next-token prediction accuracy typically drops less than 5%. The authors believe this provides a foundation for cross-layer circuit discovery, finer-grained behavior control, and scalable interpretability methods, and they provide a paper and a HuggingFace demo.
